Enterprise Vector RAG Architecture: Sub-Second Semantic Search, Chunking & Zero-Hallucination Retrieval

Executive & Architectural Key Takeaways

  • ✓Naive RAG with basic cosine similarity fails on enterprise documents; hybrid search combining dense vectors with sparse BM25 is mandatory.
  • ✓Chunking strategies must respect document semantics: recursive character splitting with 15% overlap prevents loss of context across paragraph boundaries.
  • ✓Cross-Encoder re-ranking models (like bge-reranker-large) evaluate the top 50 retrieved chunks and prune irrelevant noise before context is injected into LLM prompts.
  • ✓Enforcing strict source citation schemas in the prompt guarantees every factual assertion links back to an exact document ID and page number.

Why Naive Vector Search Fails in Production

Most proof-of-concept RAG systems built during hackathons rely on a single vector database and pure cosine similarity search. When deployed against complex corporate manuals, policy documents, and financial audits, these naive systems quickly hallucinate.

Dense vector embeddings excel at understanding broad conceptual intent (e.g. "travel policy"), but fail at exact keyword queries, technical part numbers, or legal clauses. To solve this, production enterprise RAG systems combine semantic embeddings with traditional BM25 keyword search using Reciprocal Rank Fusion (RRF).

Hybrid Vector & BM25 Search Implementation

Below is a production PostgreSQL function using pgvector and pg_trgm to execute hybrid dense-sparse search with reciprocal rank fusion scoring.

PostgreSQL Hybrid Vector + Full-Text BM25 Search Function
sql
CREATE OR REPLACE FUNCTION hybrid_document_search(
  query_text TEXT,
  query_embedding vector(1536),
  match_count INT DEFAULT 10,
  rrf_k INT DEFAULT 60
)
RETURNS TABLE (
  chunk_id UUID,
  document_title TEXT,
  chunk_content TEXT,
  hybrid_score FLOAT
) LANGUAGE plpgsql AS $$
BEGIN
  RETURN QUERY
  WITH semantic_search AS (
    SELECT id, ROW_NUMBER() OVER (ORDER BY embedding <=> query_embedding) as rank
    FROM document_chunks
    ORDER BY embedding <=> query_embedding
    LIMIT match_count * 2
  ),
  keyword_search AS (
    SELECT id, ROW_NUMBER() OVER (ORDER BY ts_rank_cd(to_tsvector('english', content), plainto_tsquery('english', query_text)) DESC) as rank
    FROM document_chunks
    WHERE to_tsvector('english', content) @@ plainto_tsquery('english', query_text)
    LIMIT match_count * 2
  )
  SELECT
    c.id as chunk_id,
    c.document_title,
    c.content as chunk_content,
    COALESCE(1.0 / (rrf_k + s.rank), 0.0) +
    COALESCE(1.0 / (rrf_k + k.rank), 0.0) AS hybrid_score
  FROM document_chunks c
  LEFT JOIN semantic_search s ON c.id = s.id
  LEFT JOIN keyword_search k ON c.id = k.id
  WHERE s.id IS NOT NULL OR k.id IS NOT NULL
  ORDER BY hybrid_score DESC
  LIMIT match_count;
END;
$$;

Cross-Encoder Re-Ranking & Context Window Optimization

Injecting 20 raw chunks into an LLM context window causes the "lost in the middle" phenomenon where models ignore information placed in the middle of long prompts.

By passing the top 25 hybrid search candidates through a cross-encoder model, we distill the context down to the 5 most statistically relevant passages, slashing token costs and eliminating hallucinations.
